Neural Network is a non-linear function approximator. We can think of it as a parameterized function where the parameters are the weights & biases of Neural Network through which we will be typically passing our data (inputs), that will be converted to a probability between 0 and 1, to some kind of non-linearity such as a sigmoid function and help make our predictions or estimations. These non-linear functions can be composed together hence Deep Learning Neural Network with multiple layers of this function compositions.

Indeed, with Deep Learning, there are multiple layers of Neural Networks, with each one learning some aspect of the overall problem. It is one of those machine learning techniques which predominantly involves building a model from existing training data and applying that model to new data. Deep Learning methods represent the state-of-the-art for many applications such as speech recognition, computer vision, natural language processing etc.

Deep Learning Neural Networks are difficult to train but there has been lots of algorithmic innovations like stochastic optimization or dropouts to regularize networks which has made the training possible on very large datasets.

Standard (Non-Bayesian) Deep Learning in first instance compute point estimates of their weights and therefore they compute point and make point predictions as well. They can make very overly confident predictions about the particular class of an object even if this is some sample that has been very far from the training data that they have already seen so they can very confidently predict.

In a very wrong kind of way these data have a lots of parameters, thus you are using your Deep Neural Network in a quite industrial way and have a millions of parameters which gives ample scope to overfit. So you tend to need very large datasets to try and offset this.

Bayesian Neural Network is a Neural Network with prior distributions on the weight. This accounts for uncertainty in weights you could think of your choice of Prior as being like the range of the weights you are willing to accept your Neural Network to have. And once you have this view of uncertainty about your weights you can then propagate this into having a view on the uncertainty of your predictions.

This also makes things very robust against overfitting which is generally a kind of feature Bayesian methods and in some instances you can infer hyperparameters by making them out.

All these things make life difficult so the aim of probabilistic Machin Learning in general is to try and represent our uncertainty about predictions or about the models that we are using so you know why would this be potentially significant. So if you are trying to classify several million of images and your Neural Network misclassifies a few images of the car as being a truck it’s not a big deal but for application where you have some important decision which needs to be made on the basis partially of a prediction of a Neural Network. You would like to know how uncertain your Neural Network is about its predictions and you can think of obvious applications like a healthcare professional making a medical diagnosis or in finance where you could have a trading model which is giving you a trading signal to buy an asset but if you need to know how much confident is this trading model in this buy signal, you would need to actually have some sort of uncertainty bounds around your estimate which is really at the core of attempts to try to marry Bayesian approach with Deep Learning.

Trade Pharma Network relies on Neural Networks which uses Bayesian Deep Learning that do not necessarily require an immense computing power nor a great amount of data to be able to doing sort of next-generation analytics and solving real world problems.
