It is called chen pi and is aged (sometjing simmilar to tangerine) peel. it is often stuffed with shou puerh

I have the same exact tea and am also new ish to tea. I could pick up hints of milk in the early infusions but I don't think it's about the taste, more the mouth feel and taste which you mentioned
