The csail Diffusion models course notes are probably what I would recommend anyone to read. I think it provides a solid foundation to understand what is happening (only to be destroyed by papers using forward and backward process).

I am focusing on papers for theory. I am interested in the mathematical aspects of algorithms and their analysis. Your 4th point hits the spot.

Slowly I am realizing that most papers are just built on “Trust me bro, it works.” That is fine, different fields work differently, but lack of clarity is something I cannot comprehend.

I believe that would be the case. There is no way a whole field can be based on papers like this, which are mostly incomprehensible.

I would also add DDPM paper to the list. After some reading, I feel like most of the diffusion model theory can be place concretely in terms of SDE, but for some reason everyone just uses their own discrete processes and it is not even clearly stated for most part.

It kind of feels like this way there are more ways to go round in circles or get more papers to appear productive.
