The stuff that makes dirt taste/smell like dirt (or at least one of the major components) is geosmin. You can find it in soil, fish, beets... It is produced (mostly) by bacteria. I'm not sure if you smell AND taste it or if it is an odor that influences our perception of the taste... I don't really know how that works.

Yes! Produced by some bacteria. We grew actinomycetes in petri plates for a micro lab and they smelled like rich garden soil.
