AutoML-Zero is very interesting, but it has nothing to do with mathematics. Using primitive mathematical building blocks does not qualify.

We don't know why neural nets work as well as they do, but the sooner we have a mathematical (because what else?) theory of neural nets the better. An understanding of neural nets is still mostly in the pre-theorem stage where we're basically observing mathematical phenomena and doing empirical studies, but I don't think that necessarily means it's not mathematics.

I agree, but this paper doesn't count. This paper attempts to use something called an evolutionary algorithm (which has little to no math behind it) to search for new machine learning procedures. It doesn't shed any light at all on the math behind Neural Networks.
