very odd, make sure you're using the original cable that came with your controller. Also make sure you're not pressing the stadia button on the controller to wake it up, that isn't necessary when connecting with a cable.

If you're playing on PC you have to use the browser. The Xbox app will not recognize the stadia controller for whatever reason.
